Pre-production hardening
In one line: Hardening is the un-glamorous checklist that turns a working demo into something you'd let a real customer touch — and that you'd let your team get paged about.
You have a working v1 that passes evals. Hardening is the layer between "it works" and "it can survive being live." That means hard cost caps (so a runaway loop doesn't surprise the CFO), latency budgets (so users don't wait 30 seconds), fallbacks (so an Anthropic outage doesn't take down checkout), and prompt-injection defenses (so a malicious customer can't make your bot leak data). Most teams discover they're missing half of this list on their first incident.
The hardening flow
Each track is a checklist. Run them in parallel; don't ship until all are green.
Cost
A single misconfigured loop can burn $5,000 in a weekend. The cost track exists to make that impossible.
- Hard $/day spend cap at the provider. Set it in the Anthropic/OpenAI console, not just in your code. Belt + suspenders.
- Per-user rate limit. A logged-in user shouldn't be able to make 10K calls/day. Token-bucket per user_id.
- Per-conversation token cap. Long agent conversations can balloon. Cap input tokens per call.

max_tokensset on every call. The default is "all of them" — that's a budget bomb. - Cheapest model that passes evals. Don't default to flagship; downgrade where evals say it's fine.
- Prompt caching enabled for stable prefixes (system prompt, retrieved docs that repeat across calls). 2026-era prompt caching saves 50-90% on input tokens for cached portions.
- Alerting on daily spend > N× forecast. Catch the runaway before the credit card maxes out.

Latency
- Streaming on every user-facing endpoint. Users tolerate 8-second total latency if tokens start in < 1s.
- Timeout configured per call (with a fallback path). Don't let one slow upstream hang the request.
- Time-to-first-token (TTFT) measured and tracked. It's the metric users feel.
- Parallel tool calls executed concurrently (
Promise.all/asyncio.gather). - Retrieval in parallel with prompt prep where possible.
- Cache retrieved chunks per query for short windows (10-60s) when traffic patterns repeat.
- Pre-warm long contexts with prompt caching so the first hit isn't a cold cache.

Reliability
- Provider failover: secondary provider as backup for outages. Even just "use OpenAI when Anthropic 5xxs" prevents most provider-incident outages.
- Retries with exponential backoff on transient errors. SDKs do this by default — verify settings.
- Graceful degradation: if AI is down, the rest of the product keeps working. Show a "drafting unavailable, please reply manually" state.
- Idempotency keys on user-visible actions (so a retry doesn't double-charge / double-email).
- Circuit breaker on upstream failures: stop hammering a broken provider; serve the fallback.
- No single point of failure in the retrieval path. If the vector DB goes down, do you still respond? Cached snippets help.
Safety
- Prompt injection defenses: sanitize untrusted text; don't let retrieved docs override system instructions. Clearly delimit user content from system content.
- Output validation: never trust LLM output for security-relevant decisions without verification. If the model emits an SQL query, validate it before executing.
- PII filtering on logs. Names, emails, tokens, credit cards — none of it should be searchable in plaintext.
- Authorization: RAG retrieval respects the user's permissions; the model never sees data the user can't see.
- Tool sandboxing: the model can request actions, but the executor enforces what's allowed for that user.
- Refusal testing: the model refuses requests outside its scope (e.g., "help me write malware") and refuses to expose system prompt.
- No raw user content in
<system>-style instruction slots. Adversarial inputs love that path.

Observability
- Every call logged with input, output, tokens, latency, model, prompt version.
- Prompt version tracked alongside each call. When something regresses, you need to know which prompt was live.
- Cost and quality dashboards. Daily $ by feature, sampled eval scores, p50/p95 latency.
- Eval suite runs in CI. Block merges on regressions.
- Trace IDs propagated through every call so a user complaint can be reconstructed.
- Sampling for human review — 1% of calls flagged for spot-checks.

Prompt caching is the single highest-ROI cost optimization in 2026. Acme's typical request has ~5K tokens of cached prefix (system prompt + the retrieved docs that repeat across user turns) and ~500 tokens of fresh user content. With caching, the per-call input cost drops from ~$0.015 to ~$0.004 — about 73% savings. One afternoon of work, sustained savings forever.
Two engineer-days, mostly checklist work:
- Cost: $20/day cap at Anthropic; per-agent rate limit of 200 calls/day; prompt caching on the system prompt + retrieved docs (saves 65% input tokens).
- Latency: streaming wired through to the agent's UI; 8s timeout per call with a "draft unavailable" fallback; reranker timeout dropped from 2s to 500ms.
- Reliability: added OpenAI as a fallback provider, gated by env flag; circuit breaker on the vector DB with a "no-RAG" graceful path.
- Safety: restructured prompt with
<<< >>>delimiters; PII scrubber on the log writer (regex pass for email/phone/cc, plus a small NER step). - Observability: wired Langfuse, set up Slack alerts on daily spend, eval suite in CI gating PRs to
main.
One surprise: the PII scrubber initially redacted every ticket number because the regex was too greedy. Caught by spot-check, fixed in 20 minutes. This is normal — hardening always has one of these.
Common anti-patterns
- "We'll add the cap later." "Later" is after you've explained the bill to leadership.
- Caching the user's input. Cache the prefix, not the per-request part. Caching user content can cross-contaminate.
- Trusting retrieved content. A malicious doc in your retrieval index is a prompt-injection vector. Validate sources.
- Logging full request bodies forever. GDPR plus retention costs. Truncate + age out.
- Treating provider failover as a checkbox. Test it. Actually flip the flag, actually serve from the backup. Surprises are expensive.
- One global rate limit. A single abusive user shouldn't be able to drain everyone's capacity.
- No kill switch. When something goes wrong, you want a single toggle that turns AI off and falls back to non-AI behavior.
- "Streaming works in the demo." Check that streaming survives every layer of your stack — CDN, gateway, load balancer. Many setups buffer and break it.
- PII filter only on logs. What about the eval set? Production logs become eval cases. The scrub has to happen at the boundary, not just at the log step.
- Cost cap that depends on the same provider you're capping. If your spend tracker uses the same API, an outage breaks the cap too. Track spend locally.
- Believing the model's safety training is enough. It isn't, for prompt injection. You need architectural defenses (delimiters, tool sandboxing, authorization), not just trust.
- "We don't need a kill switch — we have rollback." Rollback takes minutes. A kill switch takes seconds. You want both.
